Toolbox and Troubleshooting

Most teams do not implement RLHF training loops from scratch. The practical workflow is to prototype on small models, use existing trainers for SFT, DPO, or PPO, and spend most of the effort on data quality, monitoring, and evaluation.

Toolbox

  • HF TRL: ready-made PPOTrainer and DPOTrainer, KL control to a reference, and integration with Transformers, PEFT, and LoRA
  • TRLX: production-oriented RLHF loops, scalable metrics, and distributed training with tools such as Ray or DeepSpeed
  • GPT-2 family: small, fast models such as gpt2 or distilgpt2 for classroom demos before scaling
  • SFT baseline: fine-tune on curated (x,y∗)(x,y^*) examples to create π0\pi_0
  • DPO fine-tune: use DPOTrainer on (x,y+,y−)(x,y^+,y^-) with πref=π0\pi_{ref}=\pi_0 and monitor win-rate plus per-token KL
  • PPO RLHF: use PPO with reward-model scores and adaptive λ\lambda to keep KL near κ\kappa

Classroom Sandbox

For demos, start small: SFT a GPT-2-family model on curated examples, then compare DPO and PPO behavior on the same preference pairs before scaling up.

Troubleshooting

Diagnose common RLHF problems

Choose a symptom, then inspect the likely cause and the practical fix.

Common problem

Training destabilizes

Why?

Updates are too aggressive, beta is too high, or the policy is allowed to move too far from the behavior that produced the samples.

How to fix it

Lower the learning rate, tighten the PPO clip, shorten max length, raise lambda for stronger KL control, and use adaptive lambda.

The pattern to watch for: a metric improves while the behavior people actually care about gets worse.
